The primary computational cost comes from the number of agents and the iterations needed for convergence. For problems with large search spaces—such as training a neural network with millions of parameters—the fitness evaluations alone can become computationally expensive. Parallelization (using multi-core CPUs or GPUs) is often necessary to handle these tasks efficiently. However, synchronization between agents can introduce overhead, especially in distributed systems. For instance, a swarm of 10,000 agents running on a GPU might process fitness evaluations in parallel, but coordinating their updates could still create bottlenecks if not optimized.
Memory usage is another key factor. Swarm algorithms often store data about each agent’s state (e.g., current position, velocity, personal best solution) and global state (e.g., the swarm’s best solution). For high-dimensional problems, this can quickly consume RAM. ACO, for example, might require storing pheromone matrices representing paths in a graph, which grows quadratically with the number of nodes. Developers can mitigate this by using sparse data structures or distributed memory systems, but these add complexity. Additionally, real-time applications—like drone swarms navigating dynamic environments—demand low-latency computation, pushing requirements toward specialized hardware (FPGAs) or edge computing setups. Balancing these factors depends on the problem: smaller swarms and simpler fitness functions can run on laptops, while industrial-scale optimization might need cloud clusters.
